Car Accelerating At Constant Speed Without the Cruise

I am pretty new to this forum. I never got into this forum because I never had any issues with my car until last week.

I have a Toyota Corolla LE 2005 Automatic Transmission with 105k miles. I never had any issues with this car except regular maintenance works. But recently it started acting a bit weird.

The engine acceleration is not coming down whenever I let off the pedal. For example, say I am going at 40 MPH and take foot from the accelerator pedal, the car continues going at that speed like cruise is engaged. The speed may come down a little bit (maybe 5mph) after some 1 minute. But once I apply brakes, the speedometer suddenly drops and the car decelerates quickly. This happens mainly between 30-50 MPH speeds. Above 55MPH, car is acting like normal.

What will be the cause for this? any ideas?
